Matryoshka Representation Learning
An embedding training paradigm proposed by Kusupati et al. in 2022. It jointly optimizes embedding sub-vectors at multiple granularities during training, so that truncated lower-dimensional sub-vectors retain strong representational quality, allowing a single model to be reused under varying resource constraints without retraining.
Core Facts
Matryoshka Representation Learning simultaneously applies supervised loss to multiple prefix lengths of the same vector during training, forcing the model to prioritize encoding the most important semantic information into the first few dimensions of the vector.
EmbeddingGemma 2 employs Matryoshka Representation Learning technology, allowing embedding vectors to be truncated to 512, 256, or 128 dimensions without severely degrading representational quality.
Timeline (last 90 days)
EmbeddingGemma 2 outputs 768-dimensional vectors by default and supports truncating the output dimension to as low as 128 dimensions via Matryoshka Representation Learning.
MRL provides a means of dynamically balancing retrieval quality against resource consumption, suitable for on-device scenarios with limited storage and memory bandwidth.
When using MRL, 128-dimensional vectors can reduce vector database storage by approximately 6 times compared to 768-dimensional vectors.
MRL technology allows low-dimensional vectors to be used for fast filtering in coarse ranking and switching to high-dimensional vectors in fine ranking, achieving a trade-off among storage space, retrieval speed, and accuracy.
OpenAI's text-embedding-3 series employs a technology similar to MRL.

The Matryoshka technique allows vectors to be truncated directly at inference time without retraining the model, trading accuracy loss for faster retrieval and smaller storage.
